Also known as: Permutation Feature Importance
A model-agnostic method that measures feature importance via the drop in performance after shuffling a feature’s values.
DESCRIPTION
Permutation importance quantifies how much a model depends on a feature by randomly shuffling that feature and observing the decrease in a chosen performance metric. It is model-agnostic, easy to compute, and applicable to tabular data. The method helps detect leakage and confirm feature relevance. It can be biased by correlated features, where shuffled features don’t reflect counterfactuals. Using out-of-fold estimates or repeated permutations can improve robustness. It complements SHAP and other explainability tools.
ALTERNATIVE DEFINITIONS
scikit-learn
Permutation importance is a model inspection technique that can be used for any fitted estimator when the data is tabular.
Stresses model-agnostic applicability on tabular data.
Interpretable Machine Learning (Molnar)
Permutation feature importance is defined to be the decrease in a model score when a single feature’s values are randomly permuted.
Provides a crisp, metric-focused definition.

TOP QUESTIONS
Why use Permutation Importance?
It provides a simple, model-agnostic measure of a feature’s impact on predictive performance, helping validate feature relevance and detect leakage.
Category: Benefits
What metric should I use for Permutation Importance?
Use your task metric (e.g., accuracy, AUC, RMSE). The drop in this metric after permutation quantifies importance.
Category: Requirements
How many permutations are enough for Permutation Importance?
Common practice is 5–30 repeats per feature; more repeats reduce variance but increase cost.
Category: BestPractice
Does correlation affect Permutation Importance?
Yes. Correlated features can mask each other’s importance, as shuffling one may not break the predictive signal.
Category: Mistakes
Is Permutation Importance model-agnostic?
Yes, it works for any fitted model on tabular data, as it only requires predictions.
Category: Misunderstanding
How does Permutation Importance compare to SHAP?
Permutation importance is simpler and faster, but SHAP provides local attributions and handles correlations differently, at higher computational cost.
Category: Alternatives
When might Permutation Importance be misleading?
With strong feature correlations, data leakage, or unstable metrics, the measured drops can misrepresent true importance.
Category: Risk
Can Permutation Importance be used in production monitoring?
Yes, periodic permutation checks can flag drift in feature relevance and detect model degradation.
Category: Management
How to speed up Permutation Importance?
Sample rows, reduce repeats, parallelize permutations, and cache intermediate predictions when feasible.
