Off-Policy Learning

🔄Off-Policy Learning

NEW

Also known as: Off-policy reinforcement learning, Batch RL

Reinforcement learning approach that learns or evaluates a target policy from data generated by a different behavior policy.

DESCRIPTION

Off-policy learning separates the behavior policy that collects data from the target policy being learned or evaluated. Classic examples include Q-learning and off-policy evaluation using importance sampling. Replay buffers in deep RL enable reusing experience across different policies. While flexible and sample-efficient, off-policy methods face distribution shift and extrapolation errors, especially in purely offline settings. Careful corrections and conservative objectives mitigate these risks.

ALTERNATIVE DEFINITIONS

TOP QUESTIONS

How does Off-Policy Learning differ from On-Policy Learning?

Off-policy learns or evaluates a target policy using data from another behavior policy, whereas on-policy uses data generated by the current policy.

Category: Misunderstanding

Why is Off-Policy Learning useful?

It improves sample efficiency by reusing historical experience and enables evaluation without deploying new policies.

Category: Relevancy

What are common Off-Policy algorithms?

Q-learning, Deep Q-Networks (DQN), and off-policy actor-critic methods are prominent examples.

Category: Overview

What is a key risk in Off-Policy Learning?

Distribution shift and extrapolation error can cause overestimation and instability, especially in offline RL.

Category: Risks

What is importance sampling in Off-Policy Learning?

A technique that reweights returns to correct for differences between behavior and target policies.

Category: Requirements

Is Off-Policy Learning the same as Offline RL?

Not exactly. Offline RL is a special case where learning occurs from a fixed dataset without environment interaction.

Category: Misunderstanding

How do replay buffers support Off-Policy Learning?

They store experience for reuse, decoupling data collection from learning to improve efficiency.

Category: Example

Where to start learning Off-Policy Learning?

Study Q-learning and the off-policy chapters in Sutton & Barto, then examine DQN and actor-critic variants.

Category: Learning

How is Off-Policy Learning deployed in production?

Organizations use offline evaluation and A/B tests before rollout, with monitoring for drift and safety constraints.
